Most AI agent demos look impressive for five minutes. You see the model call a tool, chain a few steps together, produce a coherent output — and it feels like magic. Then you deploy it, real users hit it, and the wheels fall off.
I've been building production AI systems at Codezenic for a while now, and the failure modes are almost always the same. Not model quality. Not tooling. Architecture and error handling.
The Demo-to-Production Gap
In a demo, you craft the perfect prompt and run it once. In production, you get edge cases you never anticipated, network timeouts, malformed responses, retry storms, and users who feed the system exactly the input you warned them not to use.
The first thing I do before writing any agent code is ask: what does graceful failure look like here? If the agent can't complete its task, can it tell the user why? Can it fall back to a simpler response? Can it escalate to a human?
Structured Outputs First
One of the highest-leverage decisions early on is committing to structured outputs everywhere. Don't let your agent return free-form text that you then parse with regex. Use JSON schemas, Pydantic models, or whatever validation layer your stack supports.
This single constraint eliminates an entire class of bugs — the "the model said almost the right thing, but my parser choked" bugs that waste hours.
Think in Workflows, Not Conversations
A lot of agents are designed as open-ended chat interfaces when they should be finite state machines. If your agent's job is to process an invoice, there are maybe eight states it can be in. Model those states explicitly.
This makes the system testable, observable, and debuggable. You can write a test for each state transition. You can log which state the agent is in at any point. When something breaks in production, you know exactly where to look.
Observability Is Not Optional
Log everything. Not just errors — every tool call, every model response, every decision point. You cannot improve what you cannot measure, and AI systems behave in ways that surprise you.
I use structured logging with correlation IDs so I can trace a single user request through every step of the pipeline. When a client asks "why did it do X?" I want to be able to answer in under five minutes.
The Right Amount of Autonomy
Give your agent exactly as much autonomy as the task requires, and not a byte more. An agent that can only read data is safer than one that can write. An agent that requires approval before taking irreversible actions is safer than one that acts immediately.
Autonomy is not a feature you add at the end — it's a design decision you make at the beginning. Start locked down, then loosen constraints only when you have the observability to justify it.
Production-grade AI agents are boring by design. They handle failure gracefully, they stay within their lane, and they make it easy to understand what they did and why. The magic is in the reliability.
